Have you ever worried about your phone battery dying too quickly, or your electric vehicle’s range suddenly dropping by half? Behind these frustrations often lie complex, invisible battery failures. Keeping batteries safe hinges on the precise diagnosis of these hidden "internal injuries."

Traditional diagnostic methods, whether based on expert experience or deep learning, struggle with a hunger for scarce labeled data, poor generalization across different battery types, and a frustrating tendency to give results without explanations. Large language models (LLMs) offer a fresh approach, but they come with their own flaw: a lack of specialized domain knowledge that can lead them to confidently generate plausible-sounding but incorrect answers.

Now, a research team led by Professors Jingling Yuan, Wen Luo, and Liqiang Mai at Wuhan University of Technology, has developed a solution: BattFailScholar, a knowledge-augmented LLM framework designed specifically to tackle battery failure diagnosis. The work, with doctoral student Xin Zhang as the first author, was published in National Science Review.

Teaching AI to think like an expert

The core idea behind BattFailScholar is to provide a powerful LLM with an "expert-level" knowledge base of battery failures, allowing it to learn from historical cases and make evidence-backed diagnoses.

The framework operates in four key steps:

  1. Building a "Case Library": The team automatically extracted tens of thousands of battery failure cases from a vast collection of scientific literature and structured them into a knowledge graph. This graph links "symptoms" (like capacity fade) to materials, mechanisms, and root causes, forming complete "failure chains."
  2. Intelligent "Case Matching": When a new problem arises, the system doesn't just match keywords. It uses a "failure-feature-aware" algorithm to find the most similar reference cases in the knowledge graph.
  3. Smart "Correction" for Rare Failures: Diagnosing uncommon failures is hard because there are few examples to learn from, which can introduce noise. The team designed a "drift-aware correction" mechanism that intelligently balances the LLM's own internal knowledge with the retrieved external cases, boosting the accuracy for these rare, "long-tail" problems.
  4. Reliable Risk Assessment: BattFailScholar uses a pattern-matching voting system that aggregates information from multiple similar cases to assign a risk level of high, medium, or low, along with a confidence score, enabling more reliable risk assessment.

Impressive accuracy, ready for real challenges

Tests show BattFailScholar delivers significant improvements:

  • Sharper Diagnosis: Augmented by the framework, leading LLMs saw an average accuracy increase of 19.7% on failure diagnosis tasks, even outperforming deep learning models trained on the full dataset.
  • Cross-Chemistry Expertise: The system performed strongly across different battery types, like NMC and LFP, achieving up to 80% top-1 accuracy for diagnosing NMC battery failures.
  • Real-World Ready: The team validated BattFailScholar on real thermal runaway experimental data, where its performance matched or exceeded that of specially trained models, proving it can go "from paper to practice."

Beyond diagnosis: Uncovering unknown failure chains

BattFailScholar's strength extends further: it can assist scientists in completing incomplete failure chains recorded in the literature. In a case study on NMC batteries, the team tasked it with inferring missing mechanisms and causes based on observed phenomena. It inferred the failure causes and mechanisms with accuracies of 85.5% and 86.8% , respectively, far surpassing rule-based statistical methods. This means BattFailScholar can not only diagnose known failures but also has the potential to discover new degradation pathways.
